systems,which specify when thesystem should take the initiative to solicit further input from the user,in orderto carry out a problem solving task.Wefirst present a utility-based quantitativeframework which is dependent on modeling:whether the user has the knowl-edge the system is seeking,whether the user is willing to provide that knowledgeand whether the user would be capable of understanding the request for infor-mation from the system.Examples from the application of sports scheduling areincluded.We also discuss a qualitative version of the model,for applications withsparse data.This paper demonstrates a novel use for user models,one in whichthe system does not simply alter its generation based on the user model,but infact makes a user-specific decision about whether to interact at intelligence system is one in which both the system and the user have an active role to play in a dialogue or problem-solving process.In the past, most designers of mixed-initiative systems have simply come up with domain-specific solutions to their particular problem of interest.The aim of our research is to develop some guidelines to direct the design of mixed-initiative systems in a more principled manner.In particular,these guidelines should help to decide whether a mixed-initiative approach is suitable for a given problem and,if so,how to design and evaluate such a system.One crucial aspect of this research is the specification of when the system,in the process of reasoning,should take the initiative to request further assistance from a user.This is the central problem addressed in this paper.We are interested in developing strategies that are user-specific and whereby the system can perform some reasoning to determine the“best”course of action.This re-quires a specific approach to user modeling and the use of user models in the determi-nation of system initiative.Wefirst present a quantitative approach and demonstrate it for the application areas of sports scheduling and translation.We then comment on the usefulness of a qualitative recasting of the formula,for applications with more sparse data.We compare this research to related work on user modeling to tailor interaction,on mixed-initiative design and on utility-based models of action and interaction.Thiswork shows the importance of user modeling in designing mixed-initiative systems andhas the new feature of employing user models to vary when to interact with a user(vs.simply altering the form or content of the interaction).2A quantitative modelThe general situation addressed in this paper is the following.The system is workingon a problem and is at a point where it might benefit from asking the user a question.Should it do so?In this section,we present a utility-based quantitative approach to designing systems that are capable of making this type of decision.In particular,weadvocate that this type of decision-making should be dependent on the specific userwho is involved.Based on its user model,and on information about the difficulty of the task at hand,the system has the following information available.is the probability that the userhas the knowledge required to answer the question.is the probability that the userwould understand what the system is asking.is the probability that the user could be made to understand,by means of a clarification dialogue,for example.is the expected utility of the course of action that would be chosen after obtaining additionalinformation from the user.is the expected utility of the course of action that would be chosen by default if the user were not asked.is the expected cost of the communication.This incorporates the time required for the interaction,the degree of bother for the user(modeling whether the user is willing to interact),and how crucial the decision is believed to be.is the expected cost of engaging the user in clarification if the user does not understand the initial question.Using thesefigures,we can calculate the benefits and costs associated with interact-ing with the user in a given situation.The general reasoning is as follows.The expectedperformance gain from the interaction is the difference between the expected utilityof the best action that could be taken after further information is obtained,, and the expected utility of the best default action,.We would expect to achieve this improvement only when the user understands the question and has the needed knowledge to answer it(these conditions will hold with probability) or when the user has the knowledge,does not understand,but can be made to un-derstand through a clarification dialogue(these conditions will hold with probability).Costs are a combination of,and the additional cost of,relevant only when the user does not understand(probability=).=+=We would then ask the user if.As a domain-independent example,suppose the system has a plan,and that its score is0.7.If it can get further information from the user,it has a belief that it can construct a plan with a score of0.95.1According to the user model,and its knowledge of the task, it computes the following values:=0.9,=0.9,=0.8,=0.15, =0.3.Now,we can make the following calculations,which indicate that it makes sense to ask because the benefits exceed the Day1.There is no way to satisfy all of these constraints,because of H1and H4.Let us first assume that,since there is no way for the system to provide an acceptable schedule.There are a few possible things we might learn from the user:(1)It may be possible to add a new time slot,which willfix the problem;(2)H1can remain a hard constraint, but can be relaxed to say that no team should play two games in a row on the same day;(3)H1can be turned into a soft constraint with some associated penalty.The question is:how can we assign a value to,the expected utility of the system’s course of action if it does ask the user for help?One approach is to determine this value by reasoning about which of the three possibilities the user is likely to choose, and also about what penalty would likely be associated with the new soft constraint mentioned in the third option.Suppose that we can estimate that there is a50%chance that the user will add a new time slot that will solve everything,a30%chance that he will modify H1so that no team can play twice in a row,and a20%chance that he will turn H1into a soft constraint with a penalty of0.1.In thefirst two cases,it is possible to come up with a perfect schedule(score=1.0),while in the third case,the soft constraint would have to be violated for two teams,giving a score of0.8.Now,would be.Assume that we are certain that the user will understand the question and will have the required knowledge to help.Also,assume an interaction cost of0.15.Then:=(1.0)(1.0)(0.96-0)=0.96;=0.15=0.96-0.15=0.81,so the system will ask the user.Until now we have assumed that=0.Yet the system should be able to reason about some default course of action.Suppose the agent’s default action is to design the best schedule it can,assuming that H1has been turned into a soft constraint with some penalty.It can come up with a schedule in which two teams play twice in one day,resulting in a score of.With an expected value of0.1for such a penalty, the utility of the expected outcome if we do not ask would be=0.8.3Since was computed earlier to be0.96,the benefits would still outweigh the costs,and the user would still be consulted.Let us now consider a scenario where the system may decide not to interact.Example2.Round-robin schedule;teams A-F;15available time slots(7:30,8:30, 9:30;Days1-5).Hard constraints:H1.No team can play2games in a is for S1.However,from similar scheduling scenarios from the past,the system believes that S1will have a penalty of0.10with probability0.6 and a penalty of0.50with probability0.4.The system has come mixed-initiative interaction,interactive translation.A sample scenario is as follows.A system is translating a Spanish document into English.It has encountered a problematic word –it believes(with a60%probability)that translation A is better than translation B.It has access to a remote database of aligned documents which it could use to resolve the ambiguity.The expected utility of this approach is0.9,but it would require a lengthy search,costing both time and money.The user needs the translation quickly,and the system is only20%confident that thefinancial expenditure would be acceptable to the user.The user has been helpful with such problems in the past.There is an estimated 80%chance of success if the user is asked.The user is busy,but has indicated a willing-ness to help if necessary to achieve a high-quality translation,which is quite important in this case.The principal communication would last one minute,but there is an es-timated40%chance that the user will request additional contextual information,and such a clarification dialogue would require an additional two minutes of contact.The cost of asking the user is,where is the expected time required for communication,is the estimated“bother level”of the user,represents how crucial the decision is deemed to be,and,,and are the weights associated with each of these components.These weights could be hard-coded into the system or could be learned from experience with the user.Time is measured in minutes,and we estimate the bother level to be0.1out of1.The decision is given a score of0.7for criticality.The weights,and are0.3,0.4and0.3,respectively. Alternatively,the system can decide that it does believe the user has the knowledge it seeks,either from a stereotyping of the user or by examining the past history of interac-tions with this user,to conclude that this user knows facts of this type.Stereotypes and past history could also be used in the evaluation of the system’s beliefs about the user’s willingness and ability to understand.As for determining that the task at hand is“very important,”this would be done on the basis of the system’s view of the problem solving task.The kind of reasoning required to determine the values for conditions in the qual-itative model could also be employed in coming up with strategies for calculating the numeric values required in the quantitative formulation.For example,a user who has been unwilling to interact a certain number of times in the past could be assessed as having a certain bother cost in the cost calculation and a certain class of facts could suggest a default value for for users of a certain stereotype.4DiscussionIn addressing the problem of specifying when a system should take the initiative,in a mixed-initiative artificial intelligence system,we are advocating a particular strategy for employing user models.Our algorithm clearly relies on having a user model which indicates information about a user’s knowledge and attitudes.Other research in user modeling has studied how to employ user modeling information such as this for the purpose of tailoring output to users.Moreover,this related work has gone beyond sim-ply suggesting a change in vocabulary,depending on the user’s background.Paris[7], for instance,examines how an entire scenario of explanation may differ,depending on whether the user is novice or expert.Carberry et al.[3]highlight the difference between preferences and goals in the variation of output to a user.Ardissono and Sestero[2] study when to issue clarifying questions for a particular user,based on an evaluation of the user and the current task.Raskutti and Zukerman[8]examine what to say in light of a nuisance factor for the user.We are advocating a novel use for user models,namely to determine whether or not to interact with a user,depending on the perception of the user as indicated in the user model.This is distinctly different from altering the form or content of the generation based on information about the user.In collaborative systems such as Collagen[5],there may indeed be different forms of dialogue,depending on the user,but this is determined by the user herself,through the responses she chooses to provide to the system.In other mixed-initiative systems, the user may also exercise some control over the extent to which she is engaged in dialogue,as in the work of Litman and Pan[6],where the user may globally choose to prefer mixed-initiative or system-initiative control or the work of Walker et al.[10], where a decision is made to prefer system-initiative or mixed-initiative,for all users, based on an evaluation of user satisfaction and efficiency.To some extent,we are similar but we are providing a strategy for interaction which is user specific,still with the aims of maximizing user satisfaction and efficiency,but more clearly specified to depend on the user herself and her capabilities.Our work is also quite relevant to two research endeavours on utility-based decision-making.In the SPIRE project,Sullivan et al.[9]look at utility-based decisions in a multi-agent framework.There is a team of agents and a set of tasks that have been distributed among the various agents in the group.When an agent is presented with a potentially rewarding“outside offer,”it must decide whether or not to default on its commitment to the team in order to accept the outside offer.The utility of defaulting is based in part on a measure of the total expected income,combining the immediate income from performing the new task,the cost of defaulting on the assigned task,and the expected future income,which may be affected negatively by its decision to default on its current commitment to the team.A similar computation is then done for the utility of not defaulting,and the decision is made according to which of the two values is higher.This work therefore has some similarity to our use of the utility of possible actions,as part of the determination of when to act.At the moment,our formula only takes into account the expected current benefits,but attempting to make projections about future benefits is certainly a possibility for future work.In the Lumi`e re project,Horvitz[4]presents a model for deciding whether to act on a user’s behalf or to engage the user in dialogue,based on analysis of expected utility.The primary difference between our model and that of Horvitz is that his scenario is one in which the user would normally be performing the action in question,and the system’s decision involves whether or not to offer to start the action on the user’s behalf,while we are focusing on situations in which the system is working on something and might benefit from asking the user for help.Horvitz also considers the expected utility of dialogue with the user,compared to simply acting.This calculation is done by evaluating how likely it is that the user has the goal that the system is proposing and so is based on different factors than ours.5Conclusions and Future WorkIn this paper,we have presented a quantitative framework for determining when the system should take the initiative to interact with a user,in a mixed-initiative system.
